In today's rapidly evolving technological landscape, artificial intelligence (AI) has become an integral part of our lives, impacting everything from the products we buy to the decisions that shape our future. However, as AI continues to advance, so does the debate surrounding its transparency and accountability. Enter the world of Explainable AI (XAI), Black Box AI, and White Box AI, three distinct approaches to harnessing the power of artificial intelligence.
In this article, we'll delve into the key differences between these three approaches to AI models, explore the risks associated with Black Box AI, and discuss strategies for responsible and ethical AI use.
To begin, let's unravel the concept of Black Box AI. We asked one of our resident AI experts, our co-founder, Chief Data Scientist, and machine learning educator, Dr. Tim Oates. According to Dr. Oates, black box AI models refer to the models that are “inherently opaque, like deep neural networks with billions of parameters.” These systems have historically been favored for their ability to deliver highly accurate results, particularly in complex tasks. However, the lack of transparency in their decision-making processes has raised legal, ethical, and practical concerns.
For example, imagine relying on an AI algorithm for a critical decision, such as talent acquisition. If this algorithm operates as a black box, it becomes incredibly difficult to identify why it produces biased outputs or where errors in its logic occur. This lack of transparency also poses challenges when determining who should be held accountable for flawed or dangerous outcomes.
Researchers and software engineers have recognized these issues and developed tools like LIME (Local Interpretable Model-Agnostic Explanations), SHAP (SHAPley Additive exPlanations), ELI5 (Explain Like I'm 5), and DALEX (Descriptive Machine Learning Explanations) to make Black Box AI models as transparent as possible, while not sacrificing their powerful and extensive capabilities.
White box AI models are functionally simple decision trees. By looking at the tree, you can understand what features it is testing, and convert the tree into a set of rules that are easy to understand. Linear and logistic regression are some simple examples.
On the flip side, Explainable AI (XAI), is a newer field devoted to making black box models understandable. In essence, after a complex black box model is built, a secondary explainable model is created to work with the black box model and offer easily understandable explanations for how it reaches its conclusions. These models provide not only the results and decisions but also the rationale behind them, making them more practical for businesses and lessening concerns about transparency and accountability.
Two main factors characterize XAI models: 1) Features must be understandable, and 2) The machine learning process must be transparent. In essence, XAI empowers humans to comprehend and trust the results and outputs created by machine learning algorithms, ensuring model accuracy, fairness, transparency, and understandable outcomes.
XAI is a particularly attractive option for many healthcare applications, such as AI-powered symptom checker tools, as this allows doctors and programmers to be able to watch the model make decisions based on patient input, and understand where the insights originated.
The use of Black Box AI models on their own can present several risks and challenges, including:
AI Bias: AI bias can emerge due to prejudiced assumptions during algorithm development or biases in the training data. Cognitive biases from trainers and data scientists and incomplete or small sample sizes of training data can both contribute to AI bias [1].
Lack of Transparency and Accountability: Complex decision-making processes in Black Box AI models can be challenging for humans to follow, leading to accountability concerns. When mistakes occur, tracking the decision process becomes a daunting task. Understanding who is responsible for risks and issue mitigation in this setting becomes very difficult [2].
Lack of Flexibility: Black Box AI models may lack flexibility, limiting their adaptability to changing circumstances or requirements.
Security Flaws: The opacity of Black Box AI can hide security vulnerabilities that may be exploited by malicious actors. And should these vulnerabilities be exploited, it can then be hard to patch them without being able to fully understand the model’s behavior.
Legal and Ethical Dilemmas: Black Box AI systems can raise dilemmas related to informed consent for data usage and data collection, potentially leading to legal and ethical challenges.
In the Harvard Data Science Review, Cynthia Rudin and Joanna Radin write on a few key strategies to make Black Box AI responsible and safer:
Adding Interpretability Constraints: For complex models like deep neural networks, researchers have found ways to add interpretability constraints, making their computations more transparent.
Transparency Initiatives: Encourage initiatives that promote transparency and accountability in AI development, ensuring that AI systems are designed with ethical considerations in mind.
Expert Involvement: Involve domain experts, especially in fields like medicine, where trust in AI is critical. Experts can provide valuable insights and validation for AI decisions.
In conclusion, the distinction between Explainable AI and Black Box AI lies at the heart of responsible AI adoption. White box models in contrast, are inherently simple enough to be explainable without much effort. Explainable AI approaches can utilize the complexity of black box models safely. While Black Box AI has its merits in certain applications, it's vital to consider the risks it poses, particularly in scenarios with significant consequences. As AI continues to shape our world, transparency, accountability, and ethics must remain at the forefront of its development and deployment. By understanding the differences between these AI models and embracing responsible AI strategies, we can harness the full potential of artificial intelligence while building trust in its use.
